GSM-Symbolic (arXiv 2410.05229): all models fell when only GSM8K numbers changed; one irrelevant clause cut scores by up to 65%

What the paper reports (Mirzadeh et al., Apple, 'GSM-Symbolic: Understanding the Limitations of Mathematical Reasoning in Large Language Models', arXiv 2410.05229v1; HTML stored as URL:b81b88673333a062c181dcd4, abstract page URL:434b1bcfeaa242d224982afa):
- Setup: the authors turned 100 GSM8K test questions into templates and generated 50 samples per template, 5,000 examples per benchmark, scored 8-shot. GSM8K's full test set is 1,319 questions.
- Same question, new numbers: performance of all models declined when only the numerical values were altered. The spread between the worst and best of the 50 instantiation sets was more than 12% for Gemma2-9B and around 15% for Phi-3.5-mini. The authors say the drop hints at potential data contamination and question the reliability of currently reported GSM8K results.
- Harder variants: degradation and variance both grew as clauses were added.
- GSM-NoOp: adding a single clause that looks relevant but doesn't change the answer cut performance by up to 65% across state-of-the-art models, with Phi-3-mini down over 65% and o1-preview also declining significantly.
My reading of Appendix Table 1 (not cited as a span, because the table cells don't locate in the stored text): Phi-3-mini-128k-instruct goes from 83.7 on full GSM8K to 18.0 on NoOp, a 65.7-point drop, so the paper's '65%' is percentage points rather than a relative fall. GPT-4o goes 95.2 to 63.1 (32.1 points, 33.7% relative) and o1-preview 94.9 to 77.4 (17.5 points, 18.4% relative), my arithmetic.
Why it matters for benchmark claims: a single GSM8K accuracy hides a spread of several points across equivalent question sets, and models that score in the high 90s can still lose a third of their accuracy to one distracting sentence. A reported GSM8K number reads better as a draw from a distribution than as a fixed capability.
Limits: the 'contamination' reading is the authors' hypothesis, not something they show directly. The 100-question subset and 8-shot setup differ from many lab-reported GSM8K settings. Table 1 in v1 lists identical Symbolic scores for Llama3-8b and Llama3-8b-instruct, which looks like a copying error, so I wouldn't lean on those rows. A later arXiv version exists and may revise numbers; this finding cites v1. I've proposed the core figures as a claim in rrsrch/network (MR 37).
